Sigmoid layer
Definition
A sigmoid layer applies the logistic sigmoid function to each element of an input tensor, producing outputs between zero and one for finite inputs in exact arithmetic. It can be a separate activation operation or part of a layer that first computes weighted inputs. The activation operation itself has no learned weights; the preceding transformation may have many.
What it means
A layer can produce several bounded outputs at once. In a multilabel classifier, each output may represent the model's estimate for a different label, such as whether an article concerns business, education, or accessibility. More than one label can apply.
The word sigmoid describes the transformation, not a complete learning objective or decision policy. The same mathematical operation can appear inside a hidden layer or gate, where outputs are not class probabilities. Interpretation depends on the layer's role, targets, and training setup.
How it works
Let a preceding transformation produce a vector of scores z. The layer returns p(j) = 1/(1 + exp(minus z(j))) for each component j. Each component is transformed separately, without dividing by a sum over the other components. Its output shape therefore matches the input shape.
A dense layer with sigmoid activation includes both its learned affine transformation and this elementwise operation. A standalone sigmoid activation layer only performs the latter. During backpropagation, each activation contributes the derivative p(j) times (1 minus p(j)). Saturation near zero or one can reduce gradients passing through hidden sigmoid layers.
For binary-output training, some loss functions combine sigmoid and binary cross-entropy internally for numerical stability. Such functions expect raw logits. Applying an explicit sigmoid first and then feeding its output to a logits-based loss changes the intended computation.
Three practical examples
- A content-tagging model uses one sigmoid output per topic. A resource can receive several labels, and each topic's threshold can be selected and evaluated separately.
- A binary image classifier uses one sigmoid output for a specified positive class. Its complement represents the other class under that binary setup, while calibration and decision quality are checked separately.
- A sequence model uses a vector of sigmoid activations as a gate. Each value scales a corresponding numerical component; it is not automatically a probability about a real-world event.
Think of it this way
Imagine a panel of separate dimmers, each controlling its own light. Raising one dimmer does not require lowering another. Independent sigmoid activations behave similarly. A softmax output is more like dividing a fixed total among alternatives, which is a different operation with a different interpretation.
Worked example
A toy tagging model outputs logits [2, 1, minus 1] for three labels: business, learning, and travel. A sigmoid layer returns approximately [0.8808, 0.7311, 0.2689]. The total is about 1.8808. That is acceptable for separate label predictions because the labels can overlap.
With a threshold of 0.5 for every label, business and learning are selected. With thresholds [0.9, 0.7, 0.4], only learning is selected. The logits and sigmoid outputs have not changed; only the decision rule has.
Applying softmax to the same logits would instead give approximately [0.7054, 0.2595, 0.0351], which sum to one. These are different numbers because softmax couples the components through a shared denominator. Neither transformation makes the fictional scores well calibrated by itself. The appropriate choice depends on whether the target allows multiple labels or requires one mutually exclusive class.
Illustrative case study
Fictional Alder Guides builds a classifier for website topics. Its editorial team permits an article to belong to both business and learning. A prototype initially forces every article into exactly one category, losing useful overlapping tags.
The developers revise the target representation and output setup, then evaluate each label on held-out articles. They also inspect articles receiving no tag or several tags and document how editors should review them. The team does not assume that adding sigmoid outputs solves incomplete training labels or inconsistent editorial definitions. This invented case illustrates alignment between model outputs and the actual publishing task.
Common misconceptions and mistakes
Independent elementwise computation does not prove that the real labels are statistically independent. Shared earlier layers can encode related information, and label correlations can still exist in the data. Conversely, the sigmoid layer alone does not enforce consistency between related or mutually exclusive labels.
Do not expect its outputs to sum to one, and do not interpret every hidden sigmoid activation as a probability. Avoid applying sigmoid twice or using a logits-based loss as though it accepts probabilities. Changing an activation without checking the target encoding and loss can silently change the learning problem.
Business use
A sigmoid output layer is useful to understand when a product supports multiple simultaneous tags, attributes, or flags. Define what each output represents and whether labels can overlap before selecting the output architecture.
Evaluate per-label errors, thresholds, and calibration where probabilities are shown to users. Rare labels may require particular attention even when aggregate metrics look strong. Document whether exported model outputs are logits or probabilities so downstream software does not transform them again. Also specify what happens when every label is below threshold or when predictions violate a business rule.
People also ask
Does a sigmoid layer learn parameters?
A standalone activation does not, while a dense layer that includes sigmoid normally has learned weights and biases.
Is it suitable for exactly one of several classes?
Softmax is commonly used for that setup; the full model and objective should match the intended interpretation.
Can multiple sigmoid outputs all be high?
Yes. There is no shared sum-to-one constraint.
Check your understanding
Why can the example's output total exceed one?
Answer: Each label receives a separate sigmoid transformation, and several labels may apply.
Did changing thresholds retrain the model?
Answer: No. It changed how fixed scores were converted into decisions.
What input should a sigmoid-combining logits loss receive?
Answer: Raw logits, following that loss's documented contract, rather than already transformed probabilities.
